Why Fine-Tune vs. RAG vs. Prompting

The Fundamental Tradeoff: Knowledge vs. Style

A common mistake in enterprise engineering is attempting to use Fine-Tuning as a knowledge repository. LLMs learn style, syntax, and behavioral tone exceptionally well during fine-tuning, but they struggle to reliably memorize specific, frequently-changing facts without hallucinating.

Technique When to Use What it Teaches Maintenance Cost
Prompt Engineering Initial POC, fast experiments, simple formatting. In-context directions for existing capabilities. Very Low
RAG (Retrieval-Augmented Generation) Dynamic documentation, changing databases, verifiable citations. External facts, company docs, live inventory. Medium (Vector DB + Chunking)
Fine-Tuning (SFT / LoRA) Teaching specialized output formats (e.g., custom DSL, PySpark dialects), reducing latency, or training a small 8B model to match GPT-4 on narrow tasks. Syntax, tone, specialized classification, reasoning style. High (Requires curated dataset + GPU training)

When Data Engineers MUST Fine-Tune

  1. Custom Query Language: Your company uses an internal SQL dialect or proprietary orchestration DSL that public LLMs have never seen.
  2. Latency & Cost Reduction: Instead of passing a 4,000-token prompt with 10 few-shot examples to GPT-4o for every row in an ETL pipeline, you fine-tune an 8B Llama 3 model to output the answer with a 50-token prompt at 1/20th the cost.
  3. Strict Structured Output Determinism: Ensuring a model outputs 100% valid JSON conforming to an internal protocol without breaking on edge cases.
